🚨 One small mistake can silently break a machine learning model. Not the algorithm. Not the architecture. Sometimes it’s just the scale of the data. While learning about neural networks recently, I came across a simple but powerful concept: Normalization. 🧠 Consider this example Imagine training a model using two features: 👟 Daily steps → values in the thousands 😴 Sleep hours → values between 4 and 9 If we feed this directly into a model: Steps = 12000 Sleep = 7 Even if both features are important, the model may give more importance to the step count simply because the numbers are much larger. This can slow down learning and sometimes lead to unstable training. ⚙️ That’s where normalization helps A common formula used is: x’ = (x − xmin) / (xmax − xmin) This rescales values into a 0–1 range, allowing features with different scales to contribute more evenly. 🖼 Example from computer vision Pixel values range from 0 to 255. Most deep learning models normalize them like this: pixel_normalized = pixel / 255 So: 128 → 0.50 255 → 1.00 ✨ A very small preprocessing step, but it can make a huge difference in how efficiently a model learns. Welcome to the Bias-Variance Tradeoff. If you want to be a serious Data Scientist or ML Engineer, you must understand this: 1. High Bias (Underfitting) 📉 • What it is: Your model is too simple. It’s making massive assumptions and ignoring the actual underlying patterns. • The Result: Terrible performance on both your training data AND your testing data. • The Fix: Use a more complex model (e.g., move from Linear Regression to a Random Forest), or add more relevant features to your dataset. 2. High Variance (Overfitting) 🎢 • What it is: Your model is too complex. It literally memorized the training data, including all the random noise and outliers. • The Result: 99% accuracy in training, but it crashes and burns on new, unseen data. • The Fix: Get more training data, simplify your model, or use Regularization techniques (like L1/L2 penalties or Dropout in neural networks). The Sweet Spot 🎯 Great Machine Learning is about finding the exact balance where the model is complex enough to learn the true patterns, but simple enough to generalize to new data. When you fine-tune: • You update weights using a smaller, domain-specific dataset • Gradients push the model toward new patterns • Previously useful representations get overwritten This is especially severe when: • Dataset is small • Learning rate is high • Full-model fine-tuning is used 👉 How to mitigate this ? 1. Parameter-Efficient Fine-Tuning (PEFT) : Instead of updating the entire model, freeze the base weights and train smaller adapter matrix using LoRA. During inference, merge these adapters to base model and make the forward pass. 2. Mixed Fine-Tuning : Mix new domain data with general instruction data or Original training-style samples. 3. Implement smaller learning rate + Early stopping 4.
